AI vs machine learning vs. deep learning: Key differences

A “neural network” in the sense used by AI engineers is not literally a network of biological neurons. Rather, it is a simplified digital model that captures some of the flavor (but little of the complexity) of an actual biological brain. Artificial intelligence has mostly been focusing on a technique called deep learning.

A different type of knowledge that falls in the domain of Data Science is the knowledge encoded in natural language texts. While natural language processing has made leaps forward in past decade, several challenges still remain in which methods relying on the combination of symbolic AI and Data Science can contribute. For example, reading and understanding natural language texts requires background knowledge [34], and findings that result from analysis of natural language text further need to be evaluated with respect to background knowledge within a domain. Several research works have shown that Artificial Neural Networks — ANNs — have an appropriate inductive bias for several domains, since they can learn any input-output mapping, i.e., ANNs have the universal approximation property. On the other hand, ANNs lack the capability of explaining their decisions, since the knowledge is encoded as real-valued weights and biases of the network.

Relational inductive biases, deep learning, and graph networks

Neural networks began in the 1950s, making significant progress in the 1980s and 1990s. Deep models have added complexity, with several “hidden layers” of non-linear functions cascading between input and output. Despite initial investigations of deep neural networks back in the 1990s, high-performance computing of the time did not allow training over large datasets in realistic time periods for well over a decade. It is only more recently that we have seen the truly impressive ability of DL to solve certain classes of problem. Since the program has logical rules, we can easily trace the conclusion to the root node, precisely understanding the AI’s path.

At its core, the symbolic program must define what makes a movie watchable. Then, we must express this knowledge as logical propositions to build our knowledge base. Following this, we can create the logical propositions for the individual movies and use our knowledge base to evaluate the said logical propositions as either TRUE or FALSE. So far, we have discussed what we understand by symbols and how we can describe their interactions using relations. The final puzzle is to develop a way to feed this information to a machine to reason and perform logical computation. We previously discussed how computer systems essentially operate using symbols.

Sometimes the artificial neural network is explicitly complemented by symbolic machinery such as tree-based search in the famous AlphaGo program (Silver et al. 2016). Arguments about the exact role of this kind of knowledge, and whether the real source of power lies in the connectionist techniques or the symbolic structures, often lead to much heat but little insight. By definition, unsupervised learning doesn’t involve labeled training data and uses techniques like clustering to identify categories or patterns in data. A. It excels at pattern recognition and works well with unstructured data. ML is subdivided into several types of learning, which I will explain below. To learn these parameters, the model initially requires a definition. Instead, the AI we have today is a subset of Artificial Intelligence called Narrow AI.

Whenever one talks of some form of orthogonality in description spaces, this is in fact related to the notion of symbol, which you can oppose to entangled, irreducible descriptions. There are now several efforts to combine neural networks and symbolic AI. One such project is the Neuro-Symbolic Concept Learner (NSCL), a hybrid AI system developed by the MIT-IBM Watson AI Lab. NSCL uses both rule-based programs and neural networks to solve visual question-answering problems. As opposed to pure neural network–based models, the hybrid AI can learn new tasks with less data and is explainable. And unlike symbolic-only models, NSCL doesn’t struggle to analyze the content of images.

Advances in ML and DL research facilitate the transition from ANI to AGI by explicit instructions. But, still, it is challenging to determine how far we are from becoming aware of these levels of AI. But in their continued endeavors to fulfill the dream of creating thinking machines, scientists have invented all sorts of valuable technologies.

The role of humans in the analysis of datasets and the interpretation of analysis results has also been recognized in other domains such as in biocuration where AI approaches are widely used to assist humans in extracting structured knowledge from text [43]. The role that humans will play in the process of scientific discovery will likely remain a controversial topic in the future due to the increasingly disruptive impact Data Science and AI have on our society [3]. It will also be important to identify fundamental limits for any statistical, data-driven approach with regard to the scientific knowledge it can possibly generate. Some important domain concepts simply cannot be learned from data alone.

There is an essential dissymmetry here between the “old” agents that carry the information on how to learn, and the “new” agents that are going to acquire it, and possibly mutate it. Natural language processing focuses on treating language as data to perform tasks such as identifying topics without necessarily understanding the intended meaning. Natural language understanding, in contrast, constructs a meaning representation and uses that for further processing, such as answering questions. Data Science, due to its interdisciplinary nature and as the scientific discipline that has as its subject matter the question of how to turn data into knowledge will be the best candidate for a field from which such a revolution will originate. Intelligent machines should support and aid scientists during the whole research life cycle and assist in recognizing inconsistencies, proposing ways to resolve the inconsistencies, and generate new hypotheses. Symbolical linguistic representation is also the secret behind some intelligent voice assistants. These smart assistants leverage Symbolic AI to structure sentences by placing nouns, verbs, and other linguistic properties in their correct place to ensure proper grammatical syntax and semantic execution. A Symbolic AI system is said to be monotonic – once a piece of logic or rule is fed to the AI, it cannot be unlearned.

Similarly, they say that “[Marcus] broadly assumes symbolic reasoning is all-or-nothing — since DALL-E doesn’t have symbols and logical rules underlying its operations, it isn’t actually reasoning with symbols,” when I again never said any such thing. The first framework for cognition is symbolic AI, which is the approach based on assuming that intelligence can be achieved by the manipulation of symbols, through rules and logic operating on those symbols. The second framework is connectionism, the approach that intelligent thought can be derived from weighted combinations of activations of simple neuron-like processing units.

This can be analyzing natural language text or in the analysis of structured data coming from databases and knowledge bases. Sometimes, the challenge that a data scientist faces is the lack of data such as in the rare disease field. In these cases, the combination of methods from Data Science with symbolic representations that provide background information is already successfully being applied [9,27]. At present this remains a promise as all known successes of connectionist AI thus far have been at narrowly defined recognition and classification tasks.

Eventually, it arrives at a skill level that can beat humans, purely through trial and error. Therefore, in building an image recognition model, data would be collected, and all cats would be labeled as such. As long as there’s enough data, the model would then be able to predict if the picture it is provided displays a cat or not.
